A multi-model orchestration framework for efficient high throughput verifier-free evolutionary test-time scaling

摘要

We show that verifier-free evolution is bottlenecked by both diversity and efficiency: without external correction, repeated evolution accelerates collapse toward narrow modes, while the uniform use of a high-cost model wastes compute and quickly becomes economically impractical. We introduce Squeeze Evolve, a unified multi-model orchestration framework for verifier-free evolutionary inference. Our approach is guided by a simple principle: allocate model capability where it has the highest marginal utility. stronger models are reserved for high-impact stages, while cheaper models handle the other stages at much lower costs. This principle addresses diversity and cost-efficiency jointly while remaining lightweight. Squeeze Evolve naturally supports open-source, closed-source, and mixed-model deployments. Across AIME 2025, HMMT 2025, LiveCodeBench V6, GPQA-Diamond, ARC-AGI-2, multimodal vision benchmarks (MMMU-Pro, BabyVision), and agentic settings (Terminal-Bench~2.0), Squeeze Evolve consistently improves the cost--capability frontier over single-model evolution and achieves new state-of-the-art results on several tasks. Empirically, Squeeze Evolve reduces API cost by up to $\sim$3$\times$ and increases fixed-budget serving throughput by up to $\sim$10$\times$. On circle packing, an open-ended continuous-objective task, Squeeze Evolve is the first verifier-free evolutionary method to exceed AlphaEvolve without executing programs or using closed-weight models.

Introspective Diffusion Language Models

We show that diffusion language models lack introspective consistency, and propose I-DLM to restore AR-style self-agreement while retaining parallel decoding, yielding the first DLM that matches same-scale AR quality with strong efficiency.

摘要

Diffusion language models promise parallel generation, yet still lag behind autoregressive (AR) models in quality. We attribute this gap to a failure of introspective consistency: AR models agree with their own generations, while DLMs often do not. We define the introspective acceptance rate, which measures whether a model accepts its previously generated tokens. This reveals why AR training has a structural advantage: causal masking and logit shifting implicitly enforce introspective consistency. Motivated by this observation, we introduce Introspective Diffusion Language Model (I-DLM), a paradigm that retains diffusion-style parallel decoding while inheriting the introspective consistency of AR training. I-DLM uses a novel introspective strided decoding (ISD) algorithm, which enables the model to verify previously generated tokens while advancing new ones in the same forward pass. From a systems standpoint, we build an I-DLM inference engine on AR-inherited optimizations and further customize it with a stationary-batch scheduler. To the best of our knowledge, I-DLM is the first DLM to match the quality of its same-scale AR counterpart while outperforming prior DLMs in both model quality and practical serving efficiency across 15 benchmarks. It reaches 69.6 on AIME-24 and 45.7 on LiveCodeBench-v6, exceeding LLaDA-2.1-mini (16B) by more than 26 and 15 points, respectively. Beyond quality, I-DLM is designed for the growing demand of large-concurrency serving, delivering about 3× higher throughput than state-of-the-art DLMs.

SonicSampler: Unified Tile-Aware Kernels for LLM Sampling and Speculative Verification

Pragaash Ponnusamy · Shivam Sahni · Jue WANG · Tri Dao

SonicSampler fuses the entire LLM sampling and speculative verification pipeline into unified tile-aware kernels partitioned by an optimized 2-stage hierarchical top-k, achieving up to 16× speedup over competitive baselines.

摘要

Sampling in LLM inference comprises a combinatorial set of logit processing, token selection, and verification operations for speculative decoding. However, existing implementations either accelerate only subsets of this pipeline, rely on multiple kernel launches, or assume homogeneous sampling behavior across a batch, limiting support for dynamic serving workloads and preventing efficient CUDA Graph execution. We present **SonicSampler**, a unified suite of tile-aware Triton kernels that vertically fuses the common production sampling pipeline into a fixed, workload-aware execution model. Our kernels support dynamic per-request sampling behaviors, including grammar-constrained decoding, repetition, frequency and presence penalties, logit bias, temperature scaling, top-$k$ / top-$p$ / min-$p$ filtering, and speculative verification, entirely within a fixed set of batched kernels while remaining fully CUDA Graph-compatible. Central to our approach is a novel hierarchical two-stage top-$k$ algorithm that exploits the low-entropy structure of LLM outputs to enable efficient selection over large vocabularies and achieves up to **10x speedup** on 128K vocab sizes over competitive baselines. Across heterogeneous speculative decoding workloads, SonicSampler achieves up to **16x speedup** on draft sampling and up to **10x speedup** on target sampling and verification over state-of-the-art baselines while preserving flexible batched execution.

Thought-Level Beam Search for Reasoning

Lijie Yang · Hongyin Luo · Jiawei Zhao · Tri Dao · Ravi Netravali

Gambit is a thought-level beam search algorithm that reallocates inference compute to high-quality reasoning traces, achieving up to +6.7% accuracy gains and 68.5% token reduction over pruning and parallel sampling under strict hardware constraints.

摘要

Test-time compute scaling is a primary driver of performance in large reasoning models (LRMs), but extreme inefficiency bounds current approaches, shifting the critical question from \emph{how much} compute to spend, to \emph{where} to allocate it. We formalize test-time reasoning as a constrained compute allocation problem over partial trajectories. Under a fixed hardware budget, existing paradigms fail to actively allocate the compute to the most promising partial progress: traditional parallel sampling treats traces independently and induces severe memory bottlenecks, while subtractive pruning starves hardware and fails to actively and sufficiently shift the output distribution. To overcome this dichotomy, we introduce Gambit, an inference algorithm that executes \emph{thought-level beam search}. By periodically pruning unpromising trajectories and immediately branching from high-quality prefixes, Gambit dynamically concentrates compute onto the most promising reasoning traces via a light-weight scorer probing hidden states while maintaining continuous high hardware utilization. Extensive evaluations across multiple models and benchmarks demonstrate that Gambit strictly dominates existing baselines. Under identical hardware constraints, our method yields up to a +6.7\% absolute accuracy gain on HMMT-24 and +3.3\% on AIME-25 over pruning baselines, delivers $>2\times$ higher throughput on trace completion, and reduces total token consumption by up to 68.5\% relative to standard parallel sampling.
