HISA: Efficient Hierarchical Indexing for Fine-Grained Sparse Attention

This work replaces the DSA indexer in DeepSeek-v3.2 and GLM-5 with the more efficient HISA indexer, which preserves fine-grained indexing, delivers a 3.75× speedup, requires no training, and maintains downstream task performance.

摘要

Token-level sparse attention mechanisms, exemplified by DeepSeek Sparse Attention (DSA), achieve fine-grained key selection by scoring every historical key for each query through a lightweight indexer, then computing attention only on the selected subset. While the downstream sparse attention itself scales favorably, the indexer must still scan the entire prefix for every query, introducing an $\mathcal{O}(L^2)$ per-layer bottleneck that grows prohibitively with context length. We propose HISA (Hierarchical Indexed Sparse Attention), a plug-and-play replacement for the indexer that rewrites the search path from a flat token scan into a two-stage hierarchical procedure: (1) a block-level coarse filtering stage that scores pooled block representations to discard irrelevant regions, followed by (2) a token-level refinement stage that applies the original indexer exclusively within the retained candidate blocks. HISA preserves the token-level top-$k$ index interface consumed by the downstream Sparse MLA operator and requires no additional training. In end-to-end serving with DeepSeek-V3.2, HISA improves throughput by $1.65\times$ and time to first token by $1.70\times$ over the official DSA implementation, despite the HISA-specific operators being implemented in TileLang/Triton while the official DSA baseline uses highly optimized hand-tuned CUDA kernels. With matched TileLang implementations of both indexers, controlled microbenchmarks show up to $3.75\times$ indexer speedup at 64K context. On Needle-in-a-Haystack and LongBench, we directly replace the indexer in DeepSeek-V3.2 and GLM-5 with our HISA indexer, without any finetuning. HISA closely matches the original DSA in quality, while substantially outperforming block-sparse baselines.

Start Classifying: Categorical Critics for LLM Reinforcement Learning

HL-Gauss PPO replaces the standard MSE critic in LLM PPO with a categorical critic, yielding better policies by producing more balanced and lower-variance advantage signals under binary RLVR rewards.

摘要

Proximal Policy Optimization (PPO) for large language models typically trains its critic by mean-squared-error (MSE) regression on scalar value targets. Although scalar MSE is statistically valid for estimating the conditional expected return, sparse binary rewards in reinforcement learning with verifiable rewards (RLVR) make critic optimization and calibration especially consequential: small value errors directly distort the scalar advantages used by PPO. We study whether a classification-based training objective can improve this critic signal. HL-Gauss PPO replaces the scalar MSE head with a categorical predictor over a discretized value support, trained by cross-entropy against smoothed HL-Gauss targets. Its output is decoded to a scalar expectation for standard GAE and PPO; the actor update is therefore unchanged and is not distributional. Across mathematical reasoning, tool-augmented math, and Search-R1, and on both Qwen2.5 and Qwen3 backbones, HL-Gauss PPO consistently improves over strong PPO and DAPO baselines. Controls with one-hot, two-hot, and Bernoulli two-bin critics show that neither a larger output head nor binary classification alone explains the gains. On a common collection of reasoning prefixes, HL-Gauss improves Brier score and calibration error and yields more symmetric, lower-variance advantages. These results position categorical value learning as an effective optimization surrogate for PPO critics in RLVR.
