Reinforcement Learning with Metacognitive Feedback Elicits Faithful Uncertainty Expression in LLMs

Gabrielle Kaili-May Liu · Avi Caciularu · Gal Yona · Idan Szpektor · Arman Cohan

We introduce reinforcement learning with metacognitive feedback (RLMF) and metacognitive data selection, which outperform standard RL while encoding metacognitive awareness into LLMs, enabling generalizable, SOTA faithful confidence calibration.

摘要

Metacognition is a critical component of intelligence which describes the ability to monitor and regulate one's own cognitive processes. Yet LLMs exhibit systemic deficiencies in key metacognitive faculties: they hallucinate with high confidence, fail to recognize knowledge boundaries, and misrepresent their internal uncertainty—undermining trustworthiness and reliability. Since monitoring task performance and adapting behavior accordingly are central to metacognition, we posit that models capable of accurately judging their own performance are better positioned to improve it. We operationalize this idea via two novel mechanisms: _reinforcement learning with metacognitive feedback_ (RLMF), a paradigm to refine completion rankings during preference optimization based on the quality of a model's self-judgments of performance, and _metacognitive data selection_, which leverages similar self-judgments to identify high-value training examples, outperforming naive active learning. We apply these innovations to the problem of faithful calibration (FC), a task that is itself fundamentally metacognitive: the goal is to align expressed with intrinsic uncertainty, challenging even for frontier LLMs. We adopt a two-stage, decoupled approach, first using these methods to calibrate the faithfulness of models' self-reported confidence scores, then mapping to natural, context-adaptable linguistic uncertainty via targeted output editing. Extensive experiments show our framework achieves generalizable, state-of-the-art FC across a wide array of datasets, while preserving task accuracy. Importantly, RLMF surpasses standard RL to strengthen post-training outcomes by up to 63% while enhancing models' ability to recognize and communicate their own capability limits. This positions RLMF as a promising paradigm for encoding metacognitive awareness into LLMs toward improved abilities and alignment, and suggests metacognitive performance as an effective RL signal that can overcome limitations of prior intrinsic feedback methods.

REVERE: Reflective Evolving Research Engineer

Balaji Dinesh Gangireddi · Aniketh Garikaparthi · Manasi Patwardhan · Arman Cohan

REVERE is a self-adapting LLM agent that uses global memory of past failures to make targeted prompt edits without full rewrites, outperforming expert-crafted instructions on three research-coding benchmarks at 10x lower cost.

摘要

Existing prompt-optimization techniques rely on local signals, causing poor generalization across tasks. In addition, they also rely on weak update mechanisms, such as full-prompt rewrites or unstructured merges, which cause knowledge loss and unstable adaptation. These limitations are magnified in research-coding workflows, which involve heterogeneous repositories and weak feedback, limiting abstraction and learning across tasks. We introduce Reflective Evolving Research Engineer (REVERE), a lightweight, self-adapting agent framework that learns from a Global Training Context, distills recurring cross-repository failure modes into reusable heuristics, and applies targeted, code-based edits to agent prompts. REVERE is evaluated across settings ranging from long-horizon to single-shot benchmarks, and improves over prior expert-crafted instructions by $4.50\%$ on SUPER, $1.3\%$ on ResearchCodeBench, and $4.89\%$ on ScienceAgentBench. It does so at nearly $10$× lower cost and $2.7$× faster adaptation than existing prompt-optimization baselines, demonstrating that self-adapting agents with continual learning and global memory consolidation can meaningfully evolve their capabilities over time.

Rethinking Reward Supervision: Rubric-Conditioned Self-Distillation

Siyi Gu · Jialin Chen · Sophia Zhou · Arman Cohan · Rex Ying

We introduce a rubric-guided on-policy self-distillation framework that enables scalar reward optimization with token-level learning from structured, criterion-level feedback for open-ended reasoning.

摘要

Post-training of reasoning language models is commonly driven by supervised distillation and reinforcement learning with verifiable rewards. Distillation often relies on chain-of-thought annotations that are expensive to obtain and may themselves be noisy, incomplete, or partially incorrect; even when the final solution is correct, an imperfect rationale can interfere with learning. Reinforcement learning with verified rewards, on the other hand, typically compresses evaluative feedback into a scalar signal, obscuring which aspects of a response should be improved. We propose Rubric-Conditioned Self-Distillation, a framework that incorporates rubrics as structured, fine-grained feedback for on-policy self-distillation. Our method conditions the teacher model on criterion-level rubrics and uses it to provide token-level guidance on the student’s own sampled trajectories. This design avoids treating a single reference rationale as the sole supervision target. Instead, rubrics specify what a strong response should satisfy, enabling more fine-grained credit assignment over the reasoning process than scalar reward optimization. We instantiate this framework with a two-stage pipeline that first learns to generate task-specific rubrics and then trains a rubric-guided reasoner. We evaluate on a diverse suite of science reasoning benchmarks and results show that rubric-conditioned self-distillation effectively converts rubric-level criteria into token-level guidance over the reasoning process, surpassing GRPO by 1.0 points and OPSD by 0.9 points on average.

摘要

We present CPTCoder , a human-in-the-loop system that predicts standardized medical procedure codes from clinical text. Clinical procedure coding is an extreme multi-label classification problem over a long-tailed space of short numeric identifiers, where a single-digit difference denotes an enti...
